Replying to @MikeCheckTV :
Lightweight spackle, spread it all over with a card or something flat to really push it into the mortar lines. Let it sit for a little bit and wipe off the brick faces with a damp clothe. I tried acrylic paint but when you wipe off the brick face it wipes off the stuff in the mortar lines, oil paint worked better as you can let it dry and use mineral spirits to clean the brick face. Then I tried spackle and it works way better, you can also mix paint with the spackle to make it a dirty white.
